You could try covering up the lighter bits with black shoe polish - not too much though, you don't want to make the wheel too shiny and/or slippery.
Obviously this technique won't work if the scratches are too deep, although it might disguise it a bit.

Good suggesation. I've taken off the loose parts and it doesn't feel damaged any more and it's now just the lighter color of the underneath that shows. Maybe if I can darken this area a bit it's not visible at all anymore.
